Prevent Empty Fields from being hidden on Close

We have fields in the main panel of a Jira issue. We also have the property, jira.issue.editable = false on the close status. 
When we close the issue the empty fields in the main panel are removed/hidden. 
If I remove the property the fields are present after close. 

Is there any way to prevent the empty custom fields from disappearing without removing the property?

No. If you aren't in edit mod Jira hides all empty fields. That is just the way it works. In a past job, management made me put a default value of TBD in some fields they wanted to see in the details. We found that over half of the issues got closed with TBD instead of a value people SHOULD have put there sos that isn't a good answer to your situation. 

I really don't see the issue since they only disappear when the issue is closed and you aren't allowed to edit it.
